Chapter 6第 6 章 reduced ICA to an optimization problem: find the unmixing matrix W that maximizes the log-likelihood (6.1), or equivalently minimizes the mutual information of the outputs. This chapter turns that problem into algorithms that adjust W step by step. Three questions run through it. In which direction should W move? How does the behaviour of the algorithm depend on the unknown mixing matrix A? And which solutions are attractors, so that the algorithm actually settles on them?
The answers are, in order: along the relative or natural gradient, which needs no matrix inversion; not at all, a property called equivariance; and the separating solutions attract the algorithm when a simple condition linking the nonlinearity to the source distributions holds, and not when it fails. The same condition explains why the original Infomax algorithm separates typical super-Gaussian sources such as speech but fails on some sub-Gaussian ones, and how the extended version repairs this.
Throughout the chapter the model is square (m=n, after the PCA reduction of Section 3.6第 3.6 节 if necessary), A is invertible, and the sources are independent with zero mean. The algorithms use model densities pi that need not be the true ones. Their scores φi=−pi′/pi are the nonlinearities of the algorithm, collected in φ(y)=(φ1(y1),…,φn(yn))⊤. When the model is right, φi is the true score ψi of Definition 6.1定义 6.1.
For one observation, the log-likelihood of W is ∑ilogpi(wi⊤x)+log∣detW∣, where wi⊤ is the i-th row of W. Its expectation
对单个观测,W 的对数似然为 ∑ilogpi(wi⊤x)+log∣detW∣,其中 wi⊤ 是 W 的第 i 行。它的期望
ℓ(W)=E[i=1∑nlogpi(yi)]+log∣detW∣,y=Wx,(7.1)
is the objective of this chapter. Batch algorithms replace E by the sample average E^ over x(1),…,x(T), which turns ℓ into T1logL(W). Since ∂log∣detW∣/∂W=W−⊤ (Section A.6第 A.6 节) and ∂logpi(wi⊤x)/∂wi=−φi(yi)x, the gradient is
Setting the gradient to zero and multiplying on the right by W⊤ gives the estimating equations E[φ(y)y⊤]=I, that is, E[φi(yi)yj]=δij for all i,j. Every separating matrix satisfies the off-diagonal equations, whatever the nonlinearities: if yi and yj are multiples of two different sources, then E[φi(yi)yj]=E[φi(yi)]E[yj]=0 by independence and zero means. The diagonal equations only fix the scale of each output. This is the robustness to a wrong source model noted in Chapter 6第 6 章: the model does not move the separating points. What it decides is whether an algorithm converges to them, the subject of Section 7.5第 7.5 节.
Plain gradient ascent, W←W+μ∇ℓ(W) with a step size μ>0, has two flaws. It needs the inverse W−⊤ at every step. More seriously, its behaviour depends on A. Write the update in terms of the global matrix P=WA, using W−⊤=P−⊤A⊤, x⊤=s⊤A⊤ and y=Ps:
The fixed matrix A⊤A acts as a preconditioner chosen by nature. When A is ill-conditioned, the steps are long in some directions and very short in others, and no single step size suits all of them. Panel (a) of Figure 7.1图 7.1 shows the effect: with a condition number of 10, plain gradient ascent hardly moves in 150 iterations.
Cardoso and Laheld (1996) perturb W multiplicatively, W→(I+ε)W with a small n×n matrix ε, so that the outputs change by y→y+εy. To first order, log∣det((I+ε)W)∣=log∣detW∣+trε and logpi(yi+(εy)i)=logpi(yi)−φi(yi)∑jεijyj. Hence
where ⟨B,ε⟩=tr(B⊤ε)=∑ijbijεij is the Frobenius inner product. The matrix I−E[φ(y)y⊤] is the relative gradient; it depends on W only through the outputs. By (7.4), among relative perturbations of a given Frobenius norm, the one that increases ℓ fastest is proportional to it, which gives the update
Amari, Cichocki and Yang (1996) reached the same rule as a natural gradient, a steepest-ascent direction for a geometry adapted to the problem; Amari (1998) develops the idea in general. On the group of invertible matrices, measure a small change dW by the size of the relative change, ∥dWW−1∥F. This metric is invariant under right multiplication, W→WB, because (dWB)(WB)−1=dWW−1; right multiplication is the natural symmetry of the problem, since y=Wx=(WB)(B−1x). To find the steepest direction, maximize the first-order change ⟨∇ℓ,dW⟩ subject to ∥dWW−1∥F=δ. With dW=εW the objective is ⟨∇ℓW⊤,ε⟩ under ∥ε∥F=δ, maximized by ε∝∇ℓW⊤. The steepest direction is therefore ∇ℓ(W)W⊤W, and by (7.2)
the direction of (7.5). It is still an ascent direction, because ⟨∇ℓ,∇ℓW⊤W⟩=∥∇ℓW⊤∥F2≥0, and it vanishes exactly where the ordinary gradient does. It needs no inverse. Its online form, which uses one sample at a time, is W←W+μt(I−φ(y(t))y(t)⊤)W with y(t)=Wx(t).
Let W0,W1,… be produced by (7.5) with step sizes μk, the expectation being replaced by an average over the observed samples x(t)=As(t) (all of them in batch mode, or the current one in online mode). Then the global matrices Pk=WkA satisfy
a recursion that involves A only through the starting point P0=W0A. In particular, two mixing matrices A and A′ produce identical sequences of global matrices if the algorithm is started at W0 and at W0′=W0AA′−1, respectively.
The outputs are y(t)=Wkx(t)=WkAs(t)=Pks(t). Multiply (7.5) on the right by A. For the second claim, W0′A′=W0A, so both recursions start from the same P0 and use the same sources.
输出为 y(t)=Wkx(t)=WkAs(t)=Pks(t)。把 (7.5) 右乘 A 即得。对第二个结论,W0′A′=W0A,所以两个递推从同一个 P0 出发,并且使用相同的源。
The algorithm sees only the sources and its current global matrix. The speed of convergence, the attained accuracy and the stability of each separating point are the same for every invertible A; they are properties of the source distributions, the nonlinearities, the step sizes and the starting point P0. Cardoso and Laheld (1996) call algorithms with this property equivariant. (7.3) shows that plain gradient ascent is not equivariant. Figure 7.1图 7.1(a) compares the two on the same sources, started from the same P0, for three mixing matrices with condition numbers 1, 10 and 100: the three natural-gradient curves coincide, while the ordinary gradient slows down with the conditioning.
Figure 7.1. Dynamics of batch ICA on T=20000 samples, measured by the largest relative interference maxi=j∣pij/pii∣ of the global matrix. (a) Two Laplace sources, φ=tanh, μ=0.2, the same P0 and three mixing matrices with condition numbers c=1,10,100. The natural gradient ∇~ gives the same curve for all three (markers: c=10,100); the ordinary gradient ∇ depends on c. (b) Runs started at the separating point plus a perturbation of size 0.01, μ=0.1: matched nonlinearities (y3 for uniform sources, κ<0; tanh for Laplace sources, κ>0) stay at the finite-sample error level, mismatched ones move away to a non-separating point.
Two caveats. Equivariance is a property of the noiseless model: with x=As+n the outputs are Ps+Wn, and the noise term depends on W and hence on A (Section 11.2第 11.2 节). And it says nothing about the starting point: with W0=I the algorithm starts at P0=A, which is far from separation when A is ill-conditioned. Whitening first starts it at the orthogonal matrix P0=A~ instead, which is one good reason to whiten the data before iterating. Because performance does not depend on A, the statistical analysis of Chapter 10第 10 章 can assume A=I without loss of generality.
7.5Local stability of the separating points分离点的局部稳定性
For a small step size, the batch iteration follows, and the online iteration follows on average, the ordinary differential equation dW/dt=(I−E[φ(y)y⊤])W obtained by letting μ→0. By equivariance, as in (7.6), in global coordinates it reads
Its equilibria are the solutions of the estimating equations E[φ(y)y⊤]=I. Consider a separating one, P=ΠD; after relabelling the sources, Π=I. The off-diagonal equations hold automatically, and the diagonal ones ask for E[φi(disi)disi]=1; we assume that this equation has a solution di=0 for every i, as it does for all nonlinearities in this chapter. Since the sources are defined only up to scale (Proposition 1.3命题 1.3), we may replace si by disi. The separating point is then P=I, and the sources satisfy the normalization
Assume the normalization (7.8), continuously differentiable nonlinearities φi, and enough integrability to differentiate the expectations below under the integral sign. Then the separating point P=I of (7.7) is asymptotically stable if, for all i and all j=i,
By independence, zero means and (7.8), E[φi(si)sl]=δil, and E[φi′(si)sksj] vanishes unless k=j, when it equals kiσj2. Hence E[φi(yi)yj]=εji+kiσj2εij+o(∥ε∥). The same computation for i=j gives E[φi(yi)yi]=1+(1+mi)εii+o(∥ε∥). Since I−E[φ(y)y⊤] is itself of order ∥ε∥, multiplying it by P=I+ε changes it only at second order. The linearized flow therefore splits into the scalar equations dεii/dt=−(1+mi)εii and, for each pair i<j, the 2×2 systems
The 2×2 matrix is symmetric, so its eigenvalues are real, and the pair is stable exactly when the matrix is positive definite: positive diagonal entries and determinant σi2σj2kikj−1>0. Conversely, a negative diagonal entry or a negative determinant produces a negative eigenvalue of the matrix, that is, a growing mode. The linearization thus has only negative eigenvalues under (i)–(iii) and a positive one under any of the reversed inequalities; Lyapunov's linearization theorem gives both claims.
The conditions involve single sources and pairs of sources, never triples. With the normalization in force, write γi=kiσi2. Conditions (ii) and (iii) together say that γi>0 and γiγj>1 for all pairs. A simple sufficient condition is γi>1 for every source; if two sources have γ<1, the pair is unstable. For a Gaussian source, γi=1 whatever the nonlinearity (Exercise 7.4习题 7.4), so a Gaussian source is always on the boundary; the next result shows that the true score puts every non-Gaussian source strictly inside.
Corollary 7.3 (the true score is stable)推论 7.3(真实得分函数总是稳定的)
Let each si have a smooth density pi with finite Fisher information, let φi=ψi=−pi′/pi be its own score, and assume the boundary terms in the integrations by parts below vanish. Then (7.8) holds at the true scale, 1+mi=Var(ψi(si)si)>0, and γi=σi2E[ψi(si)2]≥1, with equality only if si is Gaussian. Consequently the separating point is asymptotically stable whenever at most one source is Gaussian.
Drop the index i and use p′=−ψp. Integration by parts gives E[ψ(s)s]=−∫sp′(s)ds=∫p=1 and k=∫ψ′p=−∫ψp′=E[ψ2]. Next, m=∫ψ′s2p=−∫ψ(2sp+s2p′)=−2+E[ψ2s2], so 1+m=E[(ψs)2]−(E[ψs])2=Var(ψ(s)s). This variance vanishes only if ψ(s)s=1 almost surely, which would force p(s)∝1/∣s∣, not a density. Finally, by the Cauchy–Schwarz inequality, 1=(E[ψ(s)s])2≤E[ψ2]E[s2]=γ, with equality only if ψ(s)=cs, that is, p Gaussian. If at most one source is Gaussian, every pair has γiγj>1, and all ki=γi/σi2>0; Theorem 7.2定理 7.2 applies.
Rescaling a variable by c divides its Fisher information by c2, so γi=σi2E[ψi(si)2] is the Fisher information Ji of the unit-variance source si/σi. The quantity that decides stability under the true model is the same one that limits the attainable accuracy in Theorem 10.10定理 10.10.
With a misspecified model the conditions can fail. Table 7.1表 7.1 lists γ for three common nonlinearities, computed by numerical quadrature after solving (7.8); in every case 1+m>1, so condition (i) holds. With φ=tanh, a pair of Laplace sources is stable (1.4142>1) but a pair of uniform sources is not (0.7622≈0.58). A uniform source paired with a Laplace source is still stable, since 0.762×1.414≈1.08, but only barely: the smallest eigenvalue of the linearization is 0.038, against 0.414 for two Laplace sources, so convergence near the solution is about ten times slower. For φ(y)=y3 one finds γ=3/(3+κ) exactly (Exercise 7.2习题 7.2), so the cubic nonlinearity favours sub-Gaussian sources. A finite-difference Jacobian of the mean flow, computed with the same quadrature, reproduces the eigenvalues predicted by (7.9) to five decimal places in all these cases.

The following script implements batch natural-gradient ICA and runs it from W0=I on two uniform and on two Laplace sources, with φ=tanh, with φ(y)=y3, and with the extended Infomax rule of Section 7.7第 7.7 节. The printed interference is the largest ratio, over the rows of P=WA, of the second-largest to the largest entry in absolute value; it is 0 for perfect separation and near 1 for an even mixture.

exactly the pattern of Table 7.1表 7.1: tanh fails on the uniform pair and y3 on the Laplace pair, where they converge to points whose outputs are roughly even mixtures of the two sources, while each succeeds on the other pair. The residual interference of about 0.01 for the successful runs is estimation error from the finite sample (Chapter 10第 10 章). Figure 7.1图 7.1(b) shows the same dichotomy as a dynamical statement: started next to the separating point, the mismatched runs move away from it.
Bell and Sejnowski (1995) arrived at the same family of algorithms from a different principle. Pass the outputs yi=wi⊤x through the logistic function g(y)=1/(1+e−y) and choose W to maximize the joint entropy of u=(g(y1),…,g(yn))⊤, the information that the bounded outputs carry about the input. Since g is increasing and y=Wx, the change-of-variables formula and Proposition 2.13命题 2.13 give
H(u)=H(x)+log∣detW∣+i=1∑nE[logg′(yi)].
Up to the constant H(x) this is the objective ℓ(W) of (7.1) with model densities pi=g′, the logistic density: Infomax is maximum likelihood with a logistic source model (Cardoso, 1997; Proposition 6.5命题 6.5). Since g′=g(1−g), the score of this model is φ(y)=2g(y)−1=tanh(y/2) (Exercise 7.1习题 7.1). Bell and Sejnowski's gradient is ∇H(u)=W−⊤+E[(1−2g(y))x⊤], where 1 is the vector of ones and g acts componentwise; this is (7.2) with φ=2g−1. They also adapt a bias w0 in y=Wx+w0, which we omit for centered data. In practice the algorithm is usually run in its natural-gradient form.
Center the data; optionally whiten them, z=Vx, so that the iteration starts from an orthogonal global matrix.
Set W=I and choose a step size μ and a block size B (B=T gives the batch algorithm).
For each block of B samples, compute y=Wx for the block and update W←W+μ(I−E^B[tanh(y/2)y⊤])W, where E^B averages over the block.
After each pass through the data, reduce μ if the change of W has grown; stop when the change falls below a tolerance.
Return W (or WV if the data were whitened).
中心化数据;可以选择先白化 z=Vx,使迭代从正交的全局矩阵出发。
令 W=I,选取步长 μ 与块大小 B(B=T 即批量算法)。
返回 W(若数据已白化,返回 WV)。
The second row of Table 7.1表 7.1 describes this algorithm. Its separating points are stable for the usual super-Gaussian laws, such as the Laplace and logistic laws, consistent with the success of Infomax on speech and on many EEG and fMRI sources, which tend to be super-Gaussian. The exact criterion is γiγj>1, not the sign of the kurtosis: a bimodal law with rare large values can have positive kurtosis and still γ<1. A pair of uniform sources, with 0.8462≈0.72<1, is unstable: Infomax cannot separate two sub-Gaussian sources of this kind, however long it runs.
that is, φi(y)=y+ηitanh(y). With ηi=−1 this is the score of the bimodal, sub-Gaussian density 21N(1,1)+21N(−1,1); with ηi=+1 it is the score of the super-Gaussian density proportional to e−y2/2/coshy. Lee et al. motivate this branch with the density proportional to pG(y)sech2y, where pG is the standard Gaussian density; the score of that density is y+2tanhy, and the rule they use, y+tanhy, is the score of the density above. The sign is chosen by the switching rule
evaluated on the current outputs, in practice on each block or after each pass through the data. The rule is exactly the stability condition of Theorem 7.2定理 7.2 in disguise.
Proposition 7.5 (the switching rule ensures stability)命题 7.5(切换规则保证稳定)
Consider a separating point of (7.10), with the sources scaled as in (7.8). If every ηi is given by (7.11) evaluated at the separated outputs yi=si, and the expression inside the sign is nonzero, then γi>1 and 1+mi>0 for every i, so the separating point is asymptotically stable.
which is positive when ηi is the sign of the bracket. Moreover mi=σi2+ηiE[sech2(si)si2]≥σi2−E[sech2(si)si2]≥0 because sech2≤1, so 1+mi≥1. With γi>1 for all i, we get ki=γi/σi2>0 and γiγj>1, and Theorem 7.2定理 7.2 applies.
For a unit-variance uniform source the bracket in (7.11) equals −0.126 and for a unit-variance Laplace source +0.148, so the rule picks the sub-Gaussian model for the first and the super-Gaussian model for the second. At the normalized scales the resulting values are γ=1.273 (uniform, η=−1) and γ=1.084 (Laplace, η=+1), both above 1, consistent with the successful extended-Infomax runs in the script of Section 7.5第 7.5 节. For a Gaussian source the bracket is zero by Stein's lemma, and the rule has nothing to choose.
7.8Step sizes, online learning and EASI步长、在线学习与 EASI
Batch iteration. With a constant step size, (7.5) is a fixed-point iteration whose linearization at a separating point is ε←ε−μL(ε), where L is the linear map of the proof of Theorem 7.2定理 7.2. Its eigenvalues ϑ are the numbers 1+mi and the eigenvalues of the pair matrices in (7.9), all real. The error contracts if and only if ∣1−μϑ∣<1 for every ϑ, that is, 0<μ<2/ϑmax when all ϑ>0. For two Laplace sources and φ=tanh the eigenvalues are 2.414, 1.214 (twice) and 0.414: any μ<0.83 converges locally, and with μ=0.5 the slowest mode shrinks by the factor 1−0.5×0.414≈0.79 per iteration. By equivariance these numbers do not depend on A.
Online learning. The online rule updates W with one sample, or a small block, at a time. With a constant step size W does not converge; it keeps fluctuating around the separating point, with a spread that shrinks as μ decreases. The mean flow (7.7) describes the average motion, so the stability conditions of Theorem 7.2定理 7.2 decide which points the online algorithm can hover around. Step sizes that decrease with ∑tμt=∞ and ∑tμt2<∞, as in stochastic approximation (Robbins & Monro, 1951), make the fluctuations die out. Online learning suits data that arrive as a stream or do not fit in memory, and it can track a mixing matrix that drifts slowly; for a fixed data set, batch or block updates are simpler to tune.
The symmetric part yy⊤−I pushes the output covariance toward I; the skew-symmetric part g(y)y⊤−yg(y)⊤ leaves the output covariance unchanged to first order when that covariance is I, and drives the rotation, with equilibrium E[gi(yi)yj]=E[yigj(yj)]. The update has the relative form H(y)W, so EASI is equivariant. Linearizing as in Theorem 7.2定理 7.2, for unit-variance sources, shows that a separating point is asymptotically stable if
λi+λj<0for all i=j,λi=E[gi(si)si−gi′(si)](7.13)
and unstable if λi+λj>0 for some pair (Exercise 7.5习题 7.5). For g(y)=y3, λi=κi, so EASI with the cubic nonlinearity separates pairs whose kurtoses sum to a negative number; for g=tanh, λ=−0.148 for a Laplace source and +0.126 for a uniform one. The same quantity E[sg(s)−g′(s)] governs FastICA in the next chapter.
The relative or natural gradient (I−E[φ(y)y⊤])W is the ordinary gradient multiplied on the right by W⊤W. It is the steepest-ascent direction for the metric ∥dWW−1∥F and needs no matrix inversion.
Natural-gradient algorithms are equivariant: in terms of the global matrix P=WA they do not depend on A, so their speed, accuracy and stability are the same for every invertible mixing matrix.
Separating points solve the estimating equations whatever the nonlinearity; whether they attract the algorithm depends on ki, mi and σi2 through conditions on single sources and pairs. With the true scores they always hold when at most one source is Gaussian.
Infomax is maximum likelihood with a logistic source model, φ(y)=tanh(y/2); its separating points are stable for typical super-Gaussian sources (Laplace, logistic) but not, for example, for a pair of uniform sources. Extended Infomax switches each output between a super- and a sub-Gaussian model by a rule that is the stability condition itself.
Batch iterations converge locally for 0<μ<2/ϑmax, where ϑmax is the largest eigenvalue of the linearization; online updates need decreasing step sizes to settle. EASI whitens and separates in one equivariant serial update and is stable when λi+λj<0 for all pairs.
Let g(u)=1/(1+e−u). (a) Show that g′=g(1−g). (b) Show that the score of the logistic density g′ is 2g−1, and that 2g(u)−1=tanh(u/2). (c) Conclude that the term 1−2g(y) in Bell and Sejnowski's gradient equals −φ(y) for the logistic model.
(a) g′(u)=e−u/(1+e−u)2=1+e−u1⋅1+e−ue−u=g(u)(1−g(u)). (b) logg′=logg+log(1−g), so (logg′)′=g′/g−g′/(1−g)=(1−g)−g=1−2g, and the score is −(logg′)′=2g−1. Multiplying numerator and denominator by eu/2, 2g(u)−1=1+e−u1−e−u=eu/2+e−u/2eu/2−e−u/2=tanh(u/2). (c) Componentwise, 1−2g(yi)=−(2g(yi)−1)=−φ(yi), so W−⊤+E[(1−2g(y))x⊤]=W−⊤−E[φ(y)x⊤], which is (7.2).
Take φ(y)=y3 and a unit-variance source s with E[s4]=3+κ. Find the scale d that solves E[φ(ds)ds]=1, and compute σ2, k, m and γ for the rescaled source ds. Which pairs of sources are stable? Check the cases of two sub-Gaussian sources, two super-Gaussian sources, a uniform and a Laplace source, and a binary (κ=−2) and a Laplace source.
E[(ds)3ds]=d4(3+κ)=1 gives d=(3+κ)−1/4 (here 3+κ=E[s4]≥(E[s2])2=1>0). For the rescaled source, σ2=d2, k=E[3d2s2]=3d2, m=E[3d2s2⋅d2s2]=3d4(3+κ)=3 and γ=kσ2=3d4=3/(3+κ). Condition (i) holds (1+m=4), and k>0 always, so a pair is stable exactly when γiγj>1, that is, (3+κi)(3+κj)<9. Two sub-Gaussian sources have both factors below 3: stable. Two super-Gaussian sources have both factors above 3: unstable. Uniform and Laplace: 1.8×6=10.8>9, unstable. Binary and Laplace: 1×6=6<9, stable.
(a) Derive (7.3) from (7.2). (b) Show that multiplying the ordinary gradient on the right by W⊤W gives an update of P in which A does not appear. (c) Show that for orthogonal A the ordinary-gradient recursion for P does not depend on A either. Why does this not make plain gradient ascent equivariant?
(a)由 (7.2) 推出 (7.3)。(b)证明把普通梯度右乘 W⊤W 后,P 的更新中不再出现 A。(c)证明当 A 为正交矩阵时,普通梯度关于 P 的递推同样与 A 无关。为什么这并不意味着普通梯度上升是等变的?

(a) From W=PA−1, W−1=AP−1 and W−⊤=P−⊤A⊤; also x⊤=s⊤A⊤ and y=Wx=Ps. Then ΔP=ΔWA=μ(P−⊤A⊤−E[φ(y)s⊤]A⊤)A=μ(P−⊤−E[φ(y)s⊤])A⊤A. (b) ∇ℓW⊤WA=(I−E[φ(y)y⊤])WA=(I−E[φ(Ps)(Ps)⊤])P, which involves only P and s. (c) If A⊤A=I, then ΔP=μ(P−⊤−E[φ(y)s⊤]), free of A. Equivariance asks for independence from every invertible A; for non-orthogonal A the factor A⊤A=I changes the recursion. This is why plain gradient ascent behaves much better on whitened data, where the remaining mixing matrix A~ is orthogonal, but still differs from the natural gradient.
(a)由 W=PA−1 得 W−1=AP−1,W−⊤=P−⊤A⊤;又 x⊤=s⊤A⊤,y=Wx=Ps。于是 ΔP=ΔWA=μ(P−⊤A⊤−E[φ(y)s⊤]A⊤)A=μ(P−⊤−E[φ(y)s⊤])A⊤A。(b)∇ℓW⊤WA=(I−E[φ(y)y⊤])WA=(I−E[φ(Ps)(Ps)⊤])P,只涉及 P 和 s。(c)若 A⊤A=I,则 ΔP=μ(P−⊤−E[φ(y)s⊤]),与 A 无关。

(a) Prove Stein's lemma: if ν∼N(0,σ2) and φ is differentiable with E∣φ′(ν)∣<∞, then E[νφ(ν)]=σ2E[φ′(ν)]. (b) Deduce that γ=1 for a Gaussian source at the normalized scale, whatever φ is. (c) For two Gaussian sources, show that the matrix in (7.9) is singular with null vector (εij,εji)∝(σi2,−σj2), and that this vector is tangent to a curve of equilibria. Interpret the result.
(a) The density p(x)=(2πσ2)−1/2e−x2/(2σ2) satisfies xp(x)=−σ2p′(x). Hence E[νφ(ν)]=∫φ(x)xp(x)dx=−σ2∫φ(x)p′(x)dx=σ2∫φ′(x)p(x)dx=σ2E[φ′(ν)]; the boundary term φ(x)p(x) vanishes at ±∞ under the integrability assumption (the standard proof writes p′ as an integral and uses Fubini's theorem to avoid any boundary term). (b) At the normalized scale, E[φ(s)s]=1, so γ=kσ2=σ2E[φ′(s)]=E[sφ(s)]=1. (c) With γi=γj=1 we have ki=1/σi2 and kj=1/σj2, so the matrix is (σj2/σi211σi2/σj2), with determinant 1−1=0; one checks directly that it maps (σi2,−σj2) to zero. Now let D=diag(σi,σj) and R(θ) a rotation. The outputs DR(θ)D−1(si,sj)⊤ are again independent Gaussians with variances σi2 and σj2, because D−1(si,sj)⊤ is standard Gaussian and rotations preserve that law; for Gaussian outputs the equations E[φi(yi)yi]=1 depend only on the variances, so every such block is an equilibrium. Its derivative at θ=0 is D(01−10)D−1=(0σj/σi−σi/σj0), and (−σi/σj,σj/σi) is proportional to (σi2,−σj2). The zero eigenvalue is the dynamical face of non-identifiability: two Gaussian sources can be rotated into each other without changing anything the algorithm can see (Exercise 1.3习题 1.3, Theorem 4.6定理 4.6).
Derive the stability condition (7.13) of EASI. Use unit-variance sources, write the mean flow of (7.12) as dP/dt=−E[H(Ps)]P, linearize at P=I+ε, and study each pair (εij,εji) in the coordinates u=εij+εji, v=εij−εji.
At P=I, E[ss⊤]=I, E[gi(si)sj]=0 for i=j, and the diagonal of the skew part is zero, so E[H(s)]=0: the separating point is an equilibrium. Since E[H]=O(∥ε∥), the linearized flow is dε/dt=−E[H(y)] to first order. The symmetric part contributes E[yy⊤]−I=ε+ε⊤. For the skew part let ai=E[gi′(si)] and bi=E[gi(si)si]. The computation in the proof of Theorem 7.2定理 7.2, with σj=1, gives E[gi(yi)yj]=biεji+aiεij and E[yigj(yj)]=bjεij+ajεji to first order, for i=j. Hence dεii/dt=−2εii and
Adding the two equations, the skew terms cancel and du/dt=−2u. Subtracting them gives dv/dt=−2(ai−bj)εij−2(bi−aj)εji; substituting εij=(u+v)/2 and εji=(u−v)/2 yields dv/dt=−cu+(λi+λj)v with c=ai+bi−aj−bj and λi=bi−ai=E[gi(si)si−gi′(si)]. The system for (u,v) is triangular, with eigenvalues −2 and λi+λj. All eigenvalues of the linearization are negative if and only if λi+λj<0 for every pair, and a pair with λi+λj>0 makes the point unstable. (The diagonal entries never cause instability: the symmetric part alone fixes the output variances.)
