Negentropy, Mutual Information and Likelihood
Information-theoretic contrasts and maximum likelihood: their equivalences, the score function, Infomax, robust negentropy approximations, and what happens when the source model is wrong.
Chapter 5第 5 章 found the sources by maximizing a measure of non-Gaussianity, justified by the central-limit heuristic, and found that kurtosis, the simplest such measure, is fragile. This chapter starts instead from first principles. There are two natural ones. The statistical principle writes down the likelihood of the ICA model and maximizes it; this requires a model for the source densities. The information-theoretic principle asks for outputs that are as independent as possible and measures dependence by mutual information; this requires no model at all. The two lead to the same place: the likelihood equals minus the mutual information of the outputs, minus a term that measures how badly the source model fits, up to a constant. For whitened data, mutual information in turn equals a constant minus the sum of the negentropies of the outputs, which turns the non-Gaussianity heuristic into an exact statement.
Along the way we meet the score function, the Infomax principle of Bell & Sejnowski (1995), which turns out to be maximum likelihood in disguise, and a key robustness property: the separating solution solves the likelihood equations for almost any source model, and only its stability depends on the model. The chapter ends with practical approximations of negentropy that keep the robustness kurtosis lacks.
Take the square model x=As with A invertible (if m>n, reduce the data to n dimensions first; Section 3.6第 3.6 节), and parametrize it by the unmixing matrix W=A−1 with rows wi⊤. Let p1,…,pn be model densities for the sources; when they are the true source densities the model is correctly specified. Since s=Wx has density ∏ipi(si), the change-of-variables formula gives the density of the observations, px(x)=∣detW∣∏ipi(wi⊤x). For independent samples x(1),…,x(T) the log-likelihood is therefore

where the expectation is under the true distribution of x. The first term rewards outputs whose values are likely under the model densities; the second prevents the trivial solution W→0, which would concentrate every output where the model densities peak. The derivatives of logpi appear everywhere, so they get a name.
Definition 6.1 (score function)
For a positive density p on R that is differentiable, except possibly at isolated points (as the Laplace density at 0), the score function is ψ(u)=−p′(u)/p(u)=−dudlogp(u). We write ψi for the score of the true density of source si and φi=−pi′/pi for the score of a model density pi. The Fisher information of a variable s with score ψ is J=E[ψ(s)2].
Two identities follow from integration by parts, provided the boundary terms vanish, for instance when up(u)→0 and p′(u)→0 as ∣u∣→∞: E[ψ(s)s]=−∫up′(u)du=∫p(u)du=1, and, when ψ is differentiable, E[ψ′(s)]=E[ψ(s)2]. For a zero-mean source with variance σ2, the Cauchy–Schwarz inequality then gives 1=E[ψ(s)s]2≤E[ψ(s)2]E[s2]=Jσ2, with equality only if ψ(s) is proportional to s, that is, only for the Gaussian. Fisher information times variance is at least one, and equals one exactly for Gaussian variables: one more way in which the Gaussian is the least structured law. Table 6.1表 6.1 lists the scores of common densities.
Table 6.1. Score functions of common densities. The kurtosis is that of the variable rescaled to unit variance. In this table, saturating scores such as tanh go with super-Gaussian densities, and scores that grow faster than linearly, such as u3 for α=4, with sub-Gaussian ones.

The gradient of the expected log-likelihood follows from ∂log∣detW∣/∂W=W−⊤ (Section A.6第 A.6 节) and ∂logpi(wi⊤x)/∂wi=−φi(yi)x:
where φ(y)=(φ1(y1),…,φn(yn))⊤. The stationary points are therefore the solutions of the estimating equationsE[φi(yi)yj]=δij. The second form, the relative gradient, is the basis of the algorithms of Chapter 7第 7 章.
The information-theoretic route measures the dependence of the outputs by their mutual information, I(y)=∑iH(yi)−H(y) (Definition 2.17定义 2.17). It is nonnegative and vanishes exactly when the outputs are independent. Since y=Wx, the joint entropy satisfies H(y)=H(x)+log∣detW∣ (Proposition 2.13命题 2.13), so
Only the marginal entropies and log∣detW∣ depend on W; the joint entropy of the data is a constant. Rescaling an output changes H(yi) and log∣detW∣ by the same amount, so I(y) is invariant under W↦ΠDW, as a measure of independence should be. By Theorem 4.6定理 4.6, if at most one source is Gaussian, the minimizers of I(y) over invertible W, where I(y)=0, are exactly the separating matrices: mutual information is a contrast function in the sense of Comon (1994). The likelihood is tied to it by an exact identity.
where py and pyi are the actual densities of y=Wx and of its components. Maximizing the likelihood therefore minimizes the sum of the mutual information of the outputs and the mismatch between their marginal densities and the model densities.
By definition, D(py∥∏ipi)=E[logpy(y)]−∑iE[logpi(yi)]=−H(y)−∑iE[logpi(yi)]. Substituting H(y)=H(x)+log∣detW∣ gives −D(py∥∏ipi)=H(x)+L(W), the first equality. For the second, insert ∏ipyi:
because the second expectation involves yi only and is therefore a divergence between marginal densities.
This decomposition (Cardoso, 1997; 1998) explains what maximum likelihood does. If the model densities are correct, both terms vanish at W=A−1, which is therefore a global maximum; by Theorem 4.6定理 4.6 every other global maximum is a separating matrix whose outputs again have the model densities. If the model is wrong, the mismatch term is positive even at separation and competes with the mutual information. ML then trades a little dependence for a better marginal fit, and the question becomes whether the trade can move the maximum away from separation (Section 6.6第 6.6 节).
Example 6.3 (the decomposition in numbers)
Let the two sources be Laplacian with unit variance and A=I, so x=s and H(x)=2(1+log2)≈2.693. Table 6.2表 6.2 evaluates (6.5) for four unmixing matrices and two models: the correct Laplace density, and the logistic density e−u/(1+e−u)2 that Infomax uses (Section 6.5第 6.5 节). The output densities were obtained by numerical convolution and the entropies by numerical integration; a Monte Carlo average of T1logL(W) over 4×106 samples reproduces every value of L to within 0.0012.
设两个源都是单位方差的拉普拉斯变量,A=I,于是 x=s,H(x)=2(1+log2)≈2.693。

The table shows three things. With the correct model the likelihood is largest at W=I, and any mixing costs mutual information (0.081 nats for the rotation). With the logistic model the mismatch term dominates: the logistic density has variance π2/3≈3.3, so outputs of unit variance fit it poorly, and the likelihood is higher at W=2I, which enlarges the outputs; this is harmless, since the scale is not identifiable anyway. Finally, the mismatch under the logistic model is smaller at the rotation (0.433) than at W=I (0.505): a wrong model can reward mixing. Here the mutual information term still wins, so separation remains the better solution, but for sub-Gaussian sources the balance can tip.
6.4Whitened data: mutual information and negentropy
For whitened data the mutual information takes a transparent form. Recall that the negentropy of a random vector with covariance C is J(y)=H(yG)−H(y), where yG is Gaussian with the same covariance; it is nonnegative, vanishes only for Gaussian vectors, and is invariant under invertible linear maps (Definition 2.19定义 2.19). For a scalar with unit variance, H(y)=21log(2πe)−J(y).
对单位方差的标量,H(y)=21log(2πe)−J(y)。
Proposition 6.4 (mutual information and negentropy)
Let z be white and y=Uz with U orthogonal. Then
I(y)=J(z)−i=1∑nJ(yi).(6.6)
If moreover z=A~s with independent unit-variance sources, then J(z)=∑iJ(si), so ∑iJ(yi)≤∑iJ(si), with equality exactly when the outputs are independent.
Since ∣detU∣=1, H(y)=H(z). The vector y is again white, so each yi has unit variance and H(yi)=21log(2πe)−J(yi), while H(z)=2nlog(2πe)−J(z). Substituting into I(y)=∑iH(yi)−H(y) gives (6.6). By invariance J(z)=J(s), and J(s)=2nlog(2πe)−∑iH(si)=∑iJ(si) because the sources are independent with unit variance. The inequality is I(y)≥0.
Minimizing mutual information over rotations is therefore the same as maximizing the sum of the marginal negentropies. The non-Gaussianity principle of Chapter 5第 5 章 is not a heuristic after all: it is an exact reformulation of independence, with negentropy in the role of kurtosis, and the sources are the rotation that concentrates all the available negentropy ∑iJ(si) in the marginals. Without whitening, the same substitution gives the identity I(y)=J(x)−∑iJ(yi)+21log(∏iVar(yi)/detCy) for any invertible W (Comon, 1994). The last term is nonnegative by Hadamard's inequality and vanishes exactly for uncorrelated outputs, so restricting the search to whitened data and rotations loses nothing.
One-unit methods maximize a single negentropy J(w⊤z) on the sphere. The entropy power inequality implies that its global maximum is attained at the source with the largest negentropy (Exercise 6.6习题 6.6), the analogue of Proposition 5.1命题 5.1. Negentropy itself, however, requires the density of y, which is why Section 6.7第 6.7 节 approximates it.
Bell & Sejnowski (1995) approached separation from the side of neural networks. A layer of units computes y=Wx and passes each output through an increasing squashing function gi:R→(0,1), giving ui=gi(yi). Their Infomax principle maximizes the information that the outputs u carry about the inputs x; for a deterministic network, or one with small output noise that does not depend on W, this amounts to maximizing the output entropy H(u). With the logistic function g(y)=1/(1+e−y), the gradient of H(u) is W−⊤+E[(1−2u)x⊤], and the resulting algorithm separated mixtures of audio signals; it became one of the first widely used ICA methods.
Bell & Sejnowski(1995)从神经网络的角度研究分离问题。
Proposition 6.5 (Infomax and maximum likelihood)命题 6.5(Infomax 与最大似然)
Let each gi be differentiable and increasing with gi′=pi, that is, gi is the distribution function of the model density pi. Then for every invertible W,
Maximizing the output entropy is therefore maximum likelihood estimation with the model densities gi′. The bound 0 is attained exactly when the outputs are independent with densities pi, that is, when u is uniform on the unit cube.
Proof.证明
The map y↦u is smooth and invertible with Jacobian diag(g1′(y1),…,gn′(yn)), and under such a map the entropy changes by the expected log-Jacobian: H(u)=H(y)+∑iE[loggi′(yi)]. With H(y)=H(x)+log∣detW∣ and gi′=pi this is H(x)+L(W), and Proposition 6.2命题 6.2 gives the divergence form. A divergence vanishes only when the two densities coincide, here when y has density ∏ipi; by the probability integral transform this happens exactly when the ui=gi(yi) are independent and uniform on (0,1).
The equivalence was pointed out by Cardoso (1997) and by Pearlmutter & Parra (1997). For the logistic g, the model density g′=g(1−g) is the logistic density of Table 6.1表 6.1, with score φ(y)=2g(y)−1=tanh(y/2); since −φ(yi)=1−2ui, the Bell–Sejnowski gradient is exactly the likelihood gradient (6.3). The logistic density has kurtosis 1.2, a super-Gaussian model. This explains why Infomax works well for speech and many natural signals, which are super-Gaussian, and why it needs a modification for sub-Gaussian sources (Section 6.6第 6.6 节). Chapter 7第 7 章 develops the natural-gradient form of the algorithm (Algorithm 7.4算法 7.4).
In practice the source densities are unknown, and maximum likelihood is run with a fixed model such as the logistic density. This is less dangerous than it sounds, because of a simple property of the estimating equations.
Proposition 6.6 (separation solves the estimating equations)
Let the sources be independent with zero mean, let φ1,…,φn be arbitrary model scores, and suppose that for each i the scale equation
E[φi(disi)disi]=1(6.8)
has a solution di=0. Then W=DA−1 with D=diag(d1,…,dn) satisfies the estimating equations E[φi(yi)yj]=δij, so it is a stationary point of L. The same holds for every ordering of the sources, with each model paired with the source it extracts.
有解 di=0。则 W=DA−1(D=diag(d1,…,dn))满足估计方程 E[φi(yi)yj]=δij,因而是 L 的驻点。
Proof.证明
Here yi=disi. For i=j, independence and E[sj]=0 give E[φi(disi)djsj]=E[φi(disi)]djE[sj]=0. For i=j the equation is the scale equation.
So separation is a stationary point of the likelihood whatever the model, as long as the scale equations can be solved; for φ=tanh or φ(u)=u3 they always can, because E[φ(ds)ds] grows continuously from 0 to ∞ as d increases. This is the basis of quasi-maximum likelihood (Pham & Garat, 1997): a crude source model suffices for a consistent estimator as long as the separating point is stable (see below), and a better model improves its accuracy (Chapter 10第 10 章). What the model does decide is whether this stationary point is a maximum of L, and hence a stable point of gradient ascent. Theorem 7.2定理 7.2 gives the conditions. Apart from a condition on single sources, 1+E[φi′(yi)yi2]>0, which holds for every model used below, they concern pairs of sources: with γi=E[φi′(yi)]E[yi2] evaluated at the separating point, the pair (i,j) is stable when γi>0, γj>0 and γiγj>1. Three facts make this concrete.
The true model is stable. With the true score, γi=E[ψi′(si)]σi2=Jiσi2≥1, with equality only for a Gaussian source (Section 6.2第 6.2 节). Every pair is stable as long as at most one source is Gaussian.
Gaussian sources sit on the boundary. For a Gaussian source, γi=1 for every model, by Stein's identity E[φ(y)y]=σ2E[φ′(y)] (Exercise 6.3
A wrong model can fail. For φ=tanh, the score of the hyperbolic secant density, γ≈0.76 for a uniform source and γ≈1.41 for a Laplacian one. For φ(u)=u3, γ=3/(3+κ) exactly, which is 1.67 for the uniform and 0.5 for the Laplace law. So tanh separates two Laplacian sources (1.412≈2.0) but not two uniform ones (0.762≈0.58), and u3 does the reverse. For the logistic model of Infomax, φ(u)=tanh(u/2), the values are 0.85 and 1.27, with the same conclusions.
Simulations of the natural-gradient algorithm of Chapter 7第 7 章, started next to the separating point, confirm these predictions for all three models: in the unstable cases the outputs drift away from the sources towards mixtures of the two, and in the stable cases they stay at the scales di given by (6.8). A uniform source paired with a Laplacian one is stable under tanh (0.76×1.41≈1.08) but not under u3 (1.67×0.5≈0.83), so for a mixture of sub- and super-Gaussian sources no single fixed model of these two types is safe. Algorithms therefore choose the model per output from the data: extended Infomax (Lee, Girolami & Sejnowski, 1999) switches each output between a super-Gaussian and a sub-Gaussian model according to a sign estimated from the current outputs (Section 7.7第 7.7 节). The one-unit contrasts of the next section are squared deviations from the Gaussian value, [EG(y)−EG(ν)]2, which treat sub- and super-Gaussian departures alike; the conditions under which a source is a local maximum of such a contrast are part of the analysis of FastICA in Chapter 8第 8 章.
Negentropy, mutual information and the likelihood all involve densities, which are hard to estimate and awkward to optimize. Practical contrasts replace the negentropy of a standardized output by a function of a few expectations. Throughout this section E[y]=0 and E[y2]=1, as holds automatically for y=w⊤z with ∥w∥=1, and ν∼N(0,1) with density ϕ. For such y, negentropy is a divergence from the Gaussian: logϕ is quadratic, so E[logϕ(y)]=E[logϕ(ν)]=−H(ν) and J(y)=H(ν)−H(y)=D(py∥ϕ).
If the density of y is close to ϕ, it can be expanded in Hermite polynomials (the Gram–Charlier expansion): py(u)≈ϕ(u)(1+6κ3H3(u)+24κ4H4(u)), with κ3=E[y3], κ4=kurt(y), H3(u)=u3−3u and H4(u)=u4−6u2+3. Expanding D(py∥ϕ) to second order in the correction gives the classical approximation of Jones & Sibson (1987),
J(y)≈121κ32+481κ42(6.9)
(Exercise 6.5习题 6.5). For symmetric outputs it reduces to kurt(y)2/48, so summed over the outputs it is Comon's contrast (5.3) up to the factor 1/48; combined with Proposition 6.4命题 6.4 this is the sense in which maximizing ∑ikurt(yi)2 approximately minimizes mutual information. It also inherits every weakness of kurtosis described in Section 5.6第 5.6 节.
Approximations with slowly growing functions
Hyvärinen (1998) built approximations from expectations of functions G that grow more slowly than polynomials. The idea is to approximate J(y) by the negentropy of the maximum-entropy density that is compatible with the observed value of E[G(y)]. For an even function G, remove from G its projections onto 1 and u2 in L2(ϕ) and normalize: G~=(G−a−bu2)/cG, with E[G~(ν)]=E[G~(ν)ν2]=0, E[G~(ν)2]=1 and
cG2=Var(G(ν))−21Cov(G(ν),ν2)2.
If η=E[G~(y)] is small, the density ϕ(u)(1+ηG~(u)) integrates to one, has mean 0, variance 1 and E[G~]=η; to first order in η it is the maximum-entropy density with these constraints, and its divergence from ϕ is 21η2 to second order. For standardized y, E[a+by2]=a+b=E[G(ν)], so η=(E[G(y)]−E[G(ν)])/cG and
For an odd G the same argument, with u in place of u2, gives J(y)≈(E[G(y)])2/(2cG2) with cG2=E[G(ν)2]−(E[νG(ν)])2, and orthonormal even and odd terms can be added. Two checks connect this with the cumulant approximation. For G(u)=u4, Var(ν4)=96 and Cov(ν4,ν2)=12, so cG2=24, kG=1/48, and EG(y)−EG(ν)=kurt(y); for the odd G(u)=u3, cG2=15−9=6 and kG=1/12. (6.9) is thus the special case of polynomial G. The two functions most used in practice (Hyvärinen, 1999) give, by numerical integration for the first and in closed form for the second (Exercise 6.4习题 6.4):
G(u)=logcoshu: EG(ν)≈0.3746 and kG≈79.0;
G(u)=−e−u2/2: EG(ν)=−1/2, cG2=1/3−9/16 and kG=24/(163−27)≈33.67.
In FastICA the constant plays no role: the one-unit contrast is [EG(w⊤z)−EG(ν)]2, maximized over the unit sphere (Chapter 8第 8 章). How accurate are these approximations? Table 6.3表 6.3 compares them with the exact negentropy of six unit-variance laws.

None of the approximations is accurate in absolute terms far from the Gaussian, which is not what they were designed for. The cumulant approximation overweights heavy tails (it gives 0.75 for the t5 law, sixteen times the true value) and returns zero for the zero-kurtosis mixture. The approximations with G are of the right size for the three super-Gaussian laws (within about 20% with −e−u2/2, within a factor of 1.7 with logcosh), react to the zero-kurtosis mixture, and underestimate strongly sub-Gaussian and skewed laws; an even G cannot see skewness at all, so for skewed sources an odd function must be added. What matters for ICA, however, is how a contrast varies across the projections of one data set, and there the approximations follow the exact negentropy closely, as Figure 6.1图 6.1 shows.

Why these approximations are more robust
The advantages over kurtosis come from the slow growth of G. First, variance: the sample average E^[G(y)] has variance Var(G(y))/T, which is finite as soon as E[G(y)2]<∞. Since 0≤logcoshu≤∣u∣, a finite variance of y suffices for G=logcosh, and −e−u2/2 is bounded, so it needs no moment at all; the sample kurtosis needs m8<∞ (Proposition 5.6命题 5.6). Second, influence: one observation x0 moves E^[G(y)] by roughly G(x0)/T, which is at most about ∣x0∣/T for logcosh and at most 1/T for −e−u2/2, against x04/T for the fourth moment. Third, sensitivity: they respond to departures from Gaussianity that leave the fourth moment unchanged. The following script compares the sample kurtosis with the logcosh statistic on Gaussian data and on the zero-kurtosis source.
import numpy as np
rng = np.random.default_rng(0)
T, runs = 10000, 300
EG_nu = 0.374567 # E log cosh(nu), nu ~ N(0, 1)
def logcosh(u):

pick = rng.random(size) < 5 / 7
return np.where(pick, rng.uniform(-np.sqrt(3), np.sqrt(3), size),
rng.laplace(0.0, 1 / np.sqrt(2), size))
sources = [("Gaussian", rng.standard_normal),
("zero-kurtosis", zero_kurtosis_source)]
for name, draw in sources:
k, g = [], []
for _ in range(runs):
y = draw(T)
y = (y - y.mean()) / y.std() # standardize
k.append(np.mean(y**4) - 3) # sample kurtosis
g.append(np.mean(logcosh(y)) - EG_nu) # E G(y) - E G(nu)
print(f"{name:14s} kurtosis {np.mean(k):+.3f} +/- {np.std(k):.3f} "
f"G-statistic {np.mean(g):+.4f} +/- {np.std(g):.4f}")
Over 300 samples of size T=10000, the sample kurtosis is +0.003±0.049 for Gaussian data and +0.017±0.230 for the zero-kurtosis source: kurtosis cannot tell them apart, and its spread is almost five times larger for the non-Gaussian law. The logcosh statistic EG(y)−EG(ν) is −0.0001±0.0008 for the Gaussian and +0.0087±0.0015 for the zero-kurtosis source, a separation of about six standard deviations. (The logarithm is written in a form that does not overflow for large ∣u∣.)
Table 6.4表 6.4 collects the contrasts of Part II and the chapters where they are turned into algorithms. They fall into two families: those built on densities (mutual information, likelihood, Infomax, negentropy), which are linked by exact identities, and their moment-based or function-based approximations (kurtosis, cumulants, G-functions). Hyvärinen, Karhunen & Oja (2001) give a textbook account of these contrasts and of the algorithms built on them.

The change of variables gives the likelihood logL(W)=∑t∑ilogpi(wi⊤x(t))+Tlog∣detW∣; its stationary points solve the estimating equations E[φi(yi)yj]=δij, with φi=−pi′/pi the model scores.
Exactly, L(W)=−H(x)−I(y)−∑iD(pyi∥pi): maximum likelihood minimizes the dependence of the outputs plus the mismatch of their marginals with the model.
For whitened data and rotations, I(y)=J(z)−∑iJ(yi): minimizing dependence is maximizing the non-Gaussianity of the outputs.
Infomax with squashing functions gi is maximum likelihood with model densities gi′; the logistic choice is a super-Gaussian model.
Separation solves the estimating equations for any source model, after rescaling; only its stability depends on the model, through the conditions γi>0 and γiγj>1 for every pair. The true score is always stable when at most one source is Gaussian, while a fixed sub- or super-Gaussian model can fail, which is why models are switched per output.
Negentropy can be approximated by 121κ32+481κ42, which inherits the weaknesses of kurtosis, or by kG[EG(y)−EG(ν)]2 with logcosh or −e−u2/2, which needs weaker moment conditions, limits the influence of outliers and sees beyond the fourth moment.
(a) Compute the score of the unit-variance Laplace density p(u)=21e−2∣u∣, and verify E[ψ(s)s]=1 and J=2. (b) Show that the score of the logistic density e−u/(1+e−u)2 is tanh(u/2) and that the score of 1/(πcoshu) is tanhu.
(a) logp(u)=−21log2−2∣u∣, so ψ(u)=2sign(u) for u=0. The mean absolute value of a Laplace variable equals its scale, here 1/2, so E[ψ(s)s]=2E∣s∣=1, and J=E[ψ(s)2]=2, which exceeds the Gaussian value 1. (b) For the logistic density, logp(u)=−u−2log(1+e−u), whose derivative is −1+2e−u/(1+e−u)=−(1−e−u)/(1+e−u)=−tanh(u/2); hence ψ(u)=tanh(u/2). For the hyperbolic secant density, logp(u)=−logπ−logcoshu, whose derivative is −tanhu, so ψ(u)=tanhu. Both scores saturate, as befits super-Gaussian densities.
Show that I(Dy)=I(y) for every invertible diagonal D, whereas L(DW) depends on D. Show that the condition ∂L(DW)/∂di=0 at D=I is the diagonal estimating equation E[φi(yi)yi]=1.
H(diyi)=H(yi)+log∣di∣ and H(Dy)=H(y)+∑ilog∣di∣, so the logarithms cancel in I(Dy)=∑iH(diyi)−H(Dy). On the other hand L(DW)=∑iE[logpi(diyi)]+log∣detW∣+∑ilog∣di∣, which changes with D unless the pi have a special form. Its derivative with respect to di is −E[φi(diyi)yi]+1/di, which at di=1 vanishes exactly when E[φi(yi)yi]=1. The diagonal estimating equations therefore only fix the scales of the outputs, the one thing that mutual information ignores; the off-diagonal equations carry the information about independence.
Let γ=E[φ′(y)]E[y2], evaluated at the scale y=ds that solves the scale equation (6.8). (a) For φ(u)=u3 and a unit-variance source with kurtosis κ, show that γ=3/(3+κ). (b) Show that γ=1 for a Gaussian source and every differentiable φ with E∣φ′(y)∣<∞, using Stein's identity E[φ(y)y]=σ2E[φ′(y)] for y∼N(0,σ2), and prove that identity. (c) Show that with the true score, γ=Jσ2≥1.
(a) The scale equation reads E[(ds)3ds]=d4E[s4]=d4(3+κ)=1. Then γ=E[3(ds)2]⋅E[(ds)2]=3d2⋅d2=3d4=3/(3+κ): above 1 for sub-Gaussian and below 1 for super-Gaussian sources. (b) The Gaussian density ϕσ satisfies uϕσ(u)=−σ2ϕσ′(u), so integrating by parts, E[φ(y)y]=−σ2∫φϕσ′=σ2∫φ′ϕσ=σ2E[φ′(y)], the boundary terms vanishing because ϕσ decays faster than any polynomial (we also assume φϕσ→0 at infinity). At the separating scale E[φ(y)y]=1, hence γ=E[φ′(y)]σ2=E[φ(y)y]=1. (c) With the true score ψ of s, the scale equation holds at d=1 because E[ψ(s)s]=1 (Section 6.2第 6.2 节), and E[ψ′(s)]=E[ψ(s)2]=J. Thus γ=Jσ2, and the Cauchy–Schwarz inequality 1=E[ψ(s)s]2≤Jσ2 gives γ≥1, with equality only for a Gaussian source.
For G(u)=−e−u2/2, compute EG(ν), VarG(ν) and Cov(G(ν),ν2), and show that kG=24/(163−27)≈33.67. (Hint: E[e−aν2]=(1+2a)−1/2 and E[ν2e−aν2]=(1+2a)−3/2 for a>−1/2.)
With a=1/2: EG(ν)=−2−1/2 and E[ν2G(ν)]=−2−3/2; with a=1: E[G(ν)2]=E[e−ν2]=3−1/2. Hence VarG(ν)=1/3−1/2 and Cov(G(ν),ν2)=−2−3/2+2−1/2=2−3/2, whose square is 1/8. Therefore cG2=1/3−1/2−1/16=1/3−9/16≈0.01485 and kG=1/(2cG2)=1/(2/3−9/8)=83/(16−93)=24/(163−27)≈33.67, where the last step multiplies numerator and denominator by 3. The small value of cG2 means that G(ν) is almost a quadratic function of ν in the L2(ϕ) sense, so small deviations of EG(y) from EG(ν) already signal substantial negentropy.
Let y have zero mean, unit variance, and third and fourth cumulants κ3,κ4, and suppose its density is p=ϕ(1+ε) with ε=6κ3H3+24κ4H4, a small correction. (a) Check that p has the stated moments up to order four, using ∫ϕHjHk=k!δjk. (b) Derive (6.9) from J(y)=D(p∥ϕ) by expanding log(1+ε) to second order.

(a) The monomials 1,u,u2 are combinations of H0,H1,H2, which are orthogonal to H3 and H4, so p integrates to one and has the mean 0 and variance 1 of ϕ. Since u3=H3+3H1, ∫u3p=6κ3∫ϕH32=6κ3⋅3!=κ3; the H4 term contributes nothing by parity. Since u4=H4+6H2+3H0, ∫u4p=3+24κ4⋅4!=3+κ4, so the fourth cumulant is κ4. (b) D(p∥ϕ)=∫ϕ(1+ε)log(1+ε). With log(1+ε)=ε−21ε2+O(ε3), we get (1+ε)log(1+ε)=ε+21ε2+O(ε3). The first term integrates to zero against ϕ by orthogonality to H0, and by orthogonality of H3 and H4,
This is the same result as (6.10) with G=u3 and G=u4: the normalized Hermite polynomials H3/6 and H4/24 are exactly the orthonormalized versions of u3 and u4, and their expectations under y are κ3/6 and κ4/24.
The entropy power inequality states that for independent random variables X and Y with densities and finite variances, e2H(X+Y)≥e2H(X)+e2H(Y), with equality only if X and Y are Gaussian (Cover & Thomas, 2006). Let s have independent unit-variance components with densities, and let y=q⊤s with ∥q∥=1. Show that J(y)≤maxiJ(si), and that if some source is non-Gaussian, equality holds only for q=±ei with J(si)=maxjJ(sj).
证明 J(y)≤maxiJ(si);并证明若有某个源非高斯,则等号仅在 q=±ei 且 J(si)=maxjJ(sj) 时成立。

By induction the inequality extends to finite sums of independent variables, e2H(∑iXi)≥∑ie2H(Xi), with equality only if all Xi are Gaussian. Apply it to Xi=qisi for the indices with qi=0. Since H(qisi)=H(si)+log∣qi∣, we have e2H(Xi)=qi2e2H(si). All the variables involved have unit variance, so H(⋅)=h−J(⋅) with h=21log(2πe), and the inequality becomes e−2J(y)≥∑iqi2e−2J(si). Since the weights qi2 sum to one, the right side is at least e−2maxiJ(si), hence J(y)≤maxiJ(si). If two or more qi are nonzero, equality would require equality in the entropy power inequality, hence Gaussian si for those indices, and then J(y)=0; so if maxjJ(sj)>0, equality forces q=±ei, and then J(y)=J(si) must be the maximum. In whitened coordinates, the global maximum of J(w⊤z) on the sphere is therefore attained exactly at the sources of largest negentropy. The argument says nothing about other local maxima; unlike Theorem 5.3定理 5.3, it does not rule them out.
